Model Serving

This week, a colleague passed their Tesla sentiment analysis model to you and would like your help to deploy it to a production environment as a serverless application via AWS Lambda.

Deliverable

  • Link to the repo that hosts Tesla sentiment analysis model

☑️ Objectives

At the end of this session, you will be able to:

  • Build and deploy a model via SAM (Serverless Application Model) CLI
  • Implement your ML App on AWS Lambda
  • Deploy your ML App to a public endpoint

Task 1. Create a repo for teslabot

  1. Create a repo named teslabot including .gitignore and a license, and add all the content inside teslabot folder to it. For the rest of assignment, you will be working on the repo.

    The structure of your local repo should look like (run tree -a .)

    .
    ├── .git
    ├── .gitignore
    ├── Dockerfile
    ├── LICENSE
    ├── README.md
    ├── app.py
    ├── events
    │   └── event.json
    ├── get_model.py
    ├── requirements.txt
    └── template.yaml

  2. Inspect each of the files and make sure you understand what they are doing.

    • get_model.py contains the code to perform the sentiment analysis.
    • app.py contains the code to handle the request and return the result.
    • requirements.txt contains the dependencies of your ML App.
    • Dockerfile contains all the commands to assemble a docker image.
    • events/event.json contains the event that triggers the sentiment analysis.
    • template.yaml defines the application's AWS resources and is required when using SAM CLI. The application uses several AWS resources, including Lambda functions and an API Gateway API. These resources are defined in the template.yaml. You can update the template to add AWS resources through the same deployment process that updates your application code.

Task 2. Build and Test Locally via SAM CLI

  1. To build and deploy your application for the first time, run the following in your shell. Keep in mind teslabot% is just the terminal location and is not to be included in your command:

    teslabot% sam build

    It can take a few minutes to complete. The SAM CLI builds a docker image from a Dockerfile and then installs dependencies defined in requirements.txt inside the docker image. The processed template file is saved in the .aws-sam/build folder.

    View the long build output from SAM CLI
    teslabot % sam build
    Your template contains a resource with logical ID "ServerlessRestApi", which is a reserved logical ID in AWS SAM. It could result in unexpected behaviors and is not recommended.

  2. Test a single function locally.

    Invoke it directly with a test event. An event is a JSON document that represents the input that the function receives from the event source. One sample event.json is provided under events directory.

    Run functions locally and invoke them with the sam local invoke command.

    teslabot% sam local invoke SentimentFunction --event events/event.json

Task 3. Deploy on AWS

  1. Generating user credentials

    • The following instructions are important if you decide to use your own AWS account. If you chose to use the AWS resources we have provided, you may skip to Setting the Credentials below.

      Select us-east-1 as the aws region for the remaining steps of the assignment.

      AWS region

    • Go to Identity and Access Management (IAM) and click on Users. Add a new user by clicking on "add users" Add User IAM

    • Pick a name for the user (let's name it sam) and give it programmatic access using access key User Details

    • Add permissions to the newly created user as the following Permissions

      PLEASE NOTE THAT IT IS CONSIDERED A BAD PRACTICE TO GIVE A USER FULL ADMIN ACCESS. IDEALLY IT SHOULD BE ATTACHED TO POLICIES ACCORDING TO THE LEAST PRIViLEGE PRINCIPLE. WE ARE STRICLY USING THIS FOR THE CURRENT ASSIGNMENT TO REDUCE ISSUES RELATED TO RUNNING IT

    • Proceed into the last step where you will be able to download the client ID and the client secret S

    • Setting the Credentials - The next step is set the credentials as environment variables. On your open terminal, run the following commands:

       export AWS_ACCESS_KEY_ID=your_access_key_id
       export AWS_SECRET_ACCESS_KEY=your_secret_access_key

    while replacing your_access_key_id and your_secret_access_key with the values you find in the csv file you downloaded earlier. If you're using our AWS resources, you will use the keys we provided you.

  2. Deployment using SAM CLI

    The command will package and deploy your application to AWS, with a series of prompts:

    sam deploy --guided
    • Stack Name: The name of the stack to deploy to CloudFormation. This should be unique to your account and region, and a good starting point would be something matching your project name.
    • AWS Region: The AWS region you want to deploy your app to.
    • Confirm changes before deploy: If set to yes, any change sets will be shown to you before execution for manual review. If set to no, the AWS SAM CLI will automatically deploy application changes. changeset
    • Allow SAM CLI IAM role creation: Many AWS SAM templates, including this example, create AWS IAM roles required for the AWS Lambda function(s) included to access AWS services. By default, these are scoped down to minimum required permissions. To deploy an AWS CloudFormation stack which creates or modifies IAM roles, the CAPABILITY_IAM value for capabilities must be provided. If permission isn't provided through this prompt, to deploy this example you must explicitly pass --capabilities CAPABILITY_IAM to the sam deploy command.
    • Save arguments to samconfig.toml: If set to yes, your choices will be saved to a configuration file inside the project, so that in the future you can just re-run sam deploy without parameters to deploy changes to your application.
    • Potential Errors - There are several areas this process can break at this point. This is where you may need to troubleshoot.
      • Error 1: Unable to upload artifact sentimentfunction:python3.9-v1 referenced by ImageUri parameter of SentimentFunction resource. The security token included in the request is invalid.
        • Fix: Please check that you entered the right access key and private access key for setting the credentials in task 3, step 1.
      • Error 2: Unable to upload artifact sentimentfunction:python3.9-v1 referenced by ImageUri parameter of SentimentFunction resource.
        • Fix: Modify your samconfig.tml and direct your image repository follows the same link in your ECR. Follow the following format.
        image_repositories = ["SentimentFunction=681261969843.dkr.ecr.us-east-1.amazonaws.com/samapp7427b055/sentimentfunction35d37012repo"]

      • Error 3: Error: Unable to upload artifact referenced by ImageUri parameter of resource.500 Server Error: Internal Server Error ("Get "https://681261969843.dkr.ecr.us-east-1.amazonaws.com/v2/": Service Unavailable")
        • Fix: Please let us know as there may be permission issues with your account.
  3. Find your API Gateway Endpoint URL in the output values displayed after deployment.

    output

    We can find the deployment on Cloud Formation stacks page

    stacks

Task 4. Testing API endpoint

  1. Open your browser on the docs route to see the API documentation. Append /docs to the API Gateway Endpoint URL for access.

    API Documentations

  2. Test your API directly by starting with clicking on "Let's try out".

    Try it out button

    and run a query. For example, change the provided request body to

    {
       "comments": [
          "This is awesome !", "Tesla is not doing great in my opinion"
          ]
    }

    The API only accepts request body that matches the format we have provided in the API definition.

    Request schema

  3. Try a request body that violates the defined request schema. Can you explain the error message?

    {"comments": "This is awesome !"}
  4. Fetch, tail, and filter Lambda function logs.

    To simplify troubleshooting, command sam logs fetches logs generated by your deployed Lambda function from the command line. In addition to printing the logs on the terminal, this command has several nifty features to help you quickly find the bug.

    Note. This command works for all AWS Lambda functions; not just the ones you deploy using SAM.

    teslabot$ sam logs  --stack-name <stack-name> --tail --region us-east-1

    You can find more information and examples about filtering Lambda function logs in the SAM CLI Documentation.

  5. Cleanup

    To delete the sample application that you created, use the AWS CLI. Assuming you used your project name for the stack name, you can run the following:

    aws cloudformation delete-stack --stack-name <stack-name> --region us-east-1

    On https://us-east-1.console.aws.amazon.com/cloudformation/home?region=us-east-1, you will notice that our stack doesn't exist anymore.

[Optional] Task 5. Resources

  1. Check the AWS SAM developer guide for an introduction to SAM specification, the SAM CLI, and serverless application concepts.

    Next, you can use AWS Serverless Application Repository to deploy ready to use Apps that go beyond hello world samples and learn how others developed their applications: AWS Serverless Application Repository main page

  2. Adding a Resource to your Application

    The application template uses AWS Serverless Application Model (AWS SAM) to define application resources. AWS SAM is an extension of AWS CloudFormation with a simpler syntax for configuring common serverless application resources such as functions, triggers, and APIs. For resources not included in the SAM specification, you can use standard AWS CloudFormation resource types.
